You could give it a shot. Try using a spray paint for plastic. Or, use a multipurpose primer to adhere to the cove base. If the adheres ok, you are able to use a regular latex paint.
There is special paint formulated for plastics and no other will adhere. It comes in spray cans. Most good hardware stores have it in the paint dept - look for plastic paint. The paint is call Krylon Fusion For Plastics.
Most commonly available aerosol paints will not adhere well to most commercial plastics. The only exception is styrene, which is commonly used for scale hobby models, but not much in normal consumer products. However, specially formulated aerosol paints are now available that will adhere to plastics.
It is possible to spray paint materials that are similar to Spandex, but the paint should be latex based so that it does not crack. Regardless of the type of paint used, the Spandex materials will need to be stable for paint to adhere well.

Try nail polish remover
If the handles are plastic, Krylon makes an excellent line of spray paint products that bonds to plastic and adheres to the surface. Most spray paint products only coat the plastic and on a surface like a handle that will be used constantly, is easily scratched or peeled. The Krylon plastic paint bonds to the plastic surface and is very durable. The one down side is if you paint the handles and don't like the results, there is no going backwards, you can't remove the paint once it has cured.
