It's probably soap. The nipples are textured in such a way that soap can get trapped in there. I have to scratch the soap off mine every week or two. Remeber that there are oil glands around the nipple. These secrete oils like skin does, accept that when sucked, it draws the oils out quickly, which is probably the taste you are getting, i have had the same problem with my girlfriend.
